The Boars were down for the majority of the match, having to chase a 22-12 half time deficit.
They were able to bring it back to 22-22 at the 60-minute mark, before an Armidale penalty goal gave them the lead with just six minutes remaining.
Swan's try with just two minutes left in the game ensured the upset didn't happen and prevented the Rams of their first win of the season.
Boars captain coach Stan Swan said the Rams are "always strong at their home ground" and his side really had to work for the win.
"We just said we wanted to put on a few good defensive sets, and the boys really did that and that ended up getting us the result in the end."
Swan said his side's discipline still needs a lot of improvement.
"We gave away a fair few penalties. We were giving them cheap ball and that's how they got all their points," he said.
Discipline has been a focus for the Boars side all season, and it will be something they will continue to work on, but Swan was proud of the way his side worked their way back into the match.
"We're really digging in for each other every week and it's good to see that," Swan said.
"We've still got a lot more work to do on our discipline and a bit more on our defence."
"Our attack is pretty good. We're scoring points, we've just got to defend them."

In the under-18s, the Boars remained undefeated with a 44-6 thrashing of the Rams, despite once again only travelling with 11 players.
Injuries, suspensions and various other reasons prevented the Boars from taking a full strength side to Armidale, and they were even down to nine players on the field at one stage.
Still, they showed they're going to be a tough side to beat in the under-18s competition yet another strong win.
"We only need 11, mate," under-18s coach Todd Mitchell laughed.
"I'm very lucky. I coach a good footy side, they're good kids. And the most important thing is they're enjoying their footy.
"They're playing for the jumper. That's what we're trying to do this year, going right through. It's a great thing for the club at the moment. Everyone is playing for the jumper this year.
"I'm not saying that hasn't happened in the past, it seems to me they're playing with a bit of pride and passion for the club."
Mitchell said that everyone contributed to the win, not wanting to single out any players, but did mention newcomer to the club Cohen Fernando, who played a full game in under-18s before backing up for another full game in A-grade.
"Hats off to him," Mitchell said.
In league-tag, the Boars made it three wins in a row with a massive win over the competition leaders.
The Boars had a slim 6-4 lead at the break before scoring 14 unanswered points in the second half to come away with a 20-4 victory.
The Boars now have the bye this weekend before the Moree derby against the Boomerangs comes around again.
