The 64-year-old was stopped after leaving the White Street business about 9.30am on Sunday.
Staff from the cafe gave chase and recovered the artwork which had been hidden under a jacket.
Police were alerted and stopped the man shortly after on Marius Street. He was issued with an infringement notice for shoplifting.
Meanwhile, tools have been stolen from a house and a ute after separate incidents in North Tamworth on the same night.
Thieves broke into a vehicle at a worksite depot off Piper Street between midday on Saturday and 7.30am on Sunday. Once inside, they stole plumbing equipment.
Various tools worth more than $1000 were also taken from a house in Blight Street, about the same time.
Police are also investigating a break-and-enter and theft from a Petra Avenue house in South Tamworth.
At 7pm on Sunday, police said an 80-year-old woman left her house secured to go out and returned home at 9pm to find the house had been hit by thieves.
The woman put her bag on the ground with several other items from the shops to investigate the break-in.
Moments later, her handbag was taken while she was inside.
Police are urging anyone with information on the incidents to contact Tamworth police on 6768 2999.
